As the number of robots in industrial sites increases, the importance of fault diagnosis is also growing. When a robot stops, the production line stops. It takes time even for skilled engineers to identify the cause of a fault, and with a decreasing number of skilled workers, this becomes an even bigger problem. Systematizing fault diagnosis knowledge enables rapid cause identification and prevention. However, creating a knowledge graph itself is labor-intensive.
A study published in Advanced Engineering Informatics presents a method for precisely constructing a fault diagnosis knowledge graph for industrial robots using large language models (LLMs). In traditional knowledge graph construction, engineers had to manually define entities and relationships, but LLMs automate this process while also improving precision.
The research established a pipeline where the LLM automatically extracts entities (fault types, causes, symptoms, parts) and relationships (cause-effect, symptom-fault, replacement-part) from robot fault diagnosis manuals, maintenance logs, sensor data, and technical documents. The extracted entities and relationships are integrated into the knowledge graph after expert validation.
Looking at the key results, LLM-based entity extraction scored more than 15% higher in the F1 score compared to existing rule-based methods. In particular, the ability to understand ambiguous expressions and abbreviations in context was a strength of the LLM. The accuracy of relationship extraction between fault causes and symptoms also improved, with the LLM capturing implicit relationships such as between "motor overheating" and "bearing wear." The constructed knowledge graph improved fault diagnosis accuracy by 20% compared to existing rule-based systems.
The core of a precise knowledge graph lies in fine-grained entities and relationships. Existing knowledge graphs remained at coarse-grained entities like "motor failure," but the LLM extracted fine-grained entities such as "motor overheating," "motor vibration," and "motor current abnormality," thereby increasing diagnostic precision.
The significance of this study is that it alleviated the bottleneck of knowledge graph construction—manual entity and relationship definition—using LLMs. The role of experts is reduced to validation and supplementation, significantly decreasing the time and cost of knowledge graph construction.
As for limitations, LLM hallucinations—the phenomenon of generating non-existent relationships—could not be completely eliminated, so expert validation is still required. Additionally, extraction accuracy drops for new fault types not present in the training data. Since fault patterns differ by robot type, domain adaptation is necessary.
If you are building a robot fault diagnosis system, try LLM-based entity extraction first. An iterative process of inputting maintenance logs and manuals into the LLM to extract entities and relationships, followed by expert validation, is efficient. Rather than full automation, a human-LLM collaboration model is currently the most practical approach.
